I'm using a Ms wireless mouse and a Ms wireless keyboard which feeds on one AA
and two AAA batteries respectively.

Most of the time I am aware to turn off the mouse when it is not in use and I never
turn off the keyboard (because it doesn't have an ON/OFF button), but the mouse
eats battery so quickly that I need to replace one battery within a week, while for
the keyboard, I forget when was the last time I replaced the batteries, probably half a
year ago.

What is probably the reason? Is it likely due to the mouse itself or the battery? The battery used for the mouse is a unknown brand while the AAA batteries for my keyboard is Energetic

It could just be due to cheap quality batterys, generally you want to try and use...

It could just be due to cheap quality batterys, generally you want to try and use energizer or duralast's some hight quality battery. However that being said turning on and off the mouse usually uses more power then just waking the mouse up from sleep mode generally wireless mouses and keyboards should but themselfs to sleep after like 4 minutes of inactivaty
