Disconnect all case fans, usb connections, etc and try to power on PC with as minimum as possible parts. Just use one module of RAM. This way you may figure out something.

Your PSU might be OK. However, to be sure about the proper functioning of the PSU you can use the paper clip technique. I just want to eliminate the PSU issue so you can go to test other parts.

Can you hear a click sound from PSU after that 2 seconds?

Might be PSU issue. Do you have another PSU to test?

So, it seems there is no way other than swapping VGA. Any second-hand /cheap card or one borrowed from someone will help you.

The VGA seems to be the most probable cause of the problem. Since your CPU does not have an integrated graphics, there would be no way other than swapping VGA. Not a solution, but, disconnect VGA from MB and PSU then power on PC and look what happens to the LEDs on the MB.
